What does this PR do?

Type of change: Bug fix

Rewritten 2026-10-02 to describe what the branch actually does. The first version described a composed-permutation approach that review replaced; that machinery is gone.

qdq_to_dq() assumed DequantizeLinear feeds Conv/Gemm/MatMul directly, tolerating only a Cast in between. A weight that reaches MatMul transposed — as in MaxViT's attention blocks — put Transpose in front of _convert_weight, which has no entry for it:

RuntimeError: Failed to convert node .../qkv/weight_quantizer/QuantizeLinear:
Unsupported op_type for real weight quantization: Transpose

Two changes, and the second is the one that matters.

1. Trace Cast/Transpose to reach the real consumer. That walk now exists only to find the node whose op type decides whether this conversion supports the weight at all.

2. Take the quantization axis from the Q/DQ pair, not from the consumer. After conversion the DequantizeLinear stays in the graph with its input rewired to the weight initializer, so its axis is what indexes the stored weight — regardless of any Transpose downstream. The conversion follows that axis, defaulting to ONNX's axis = 1 when the attribute is omitted. No permutation is composed and there is no consumer-axis fallback.

That also fixes a case that is broken on main today and has nothing to do with Transpose. Measured end to end under onnxruntime, square weight into MatMul:

Q/DQ axis Transpose on main this PR
0 no silently wrong (max diff 4.62) correct
0 yes raises Unsupported op_type correct
1 no correct correct
1 yes n/a (raised before this PR) correct

A wrong axis on a square weight still satisfies the scale-length check, so nothing raises and the model simply computes something else.

Two smaller consequences of making the Q/DQ pair authoritative:

  • A single-element scale covers the whole weight, so it broadcasts and no axis applies to it. It no longer borrows the consumer's axis, which only worked when that dimension happened to be 1 — a (1, 32) single-output projection failed before. A scalar scale converts as well, which is also the subject of fix(onnx): support per-tensor scales in qdq_to_dq #2613.
  • A per-axis Q/DQ pair that disagrees on the axis now raises instead of silently following the DQ and dropping the Q. Effective axes are compared, so declaring axis on only one side is not a disagreement.

With nothing left reading the per-op axis values, axis_map became the set of supported consumers it was really being used as.

Testing

TestQdqToDqTranspose, 10 cases, each failing on main:

  • test_conversion_matches_qdq — 5 combinations of shape x axis x transpose x declared/omitted axis, comparing onnxruntime output before and after conversion
  • test_dq_transpose_without_perm_is_traced — ONNX lets Transpose omit perm
  • test_one_element_scale_broadcasts_through_transpose — (1, 32) and (32, 1)
  • test_one_element_scale_is_not_per_axis — single-output Conv
  • test_disagreeing_qdq_axes_raise

On the model from #2442: a quantized maxvit_tiny_rw_256 exported with dq_only=True raises on main and exports here, and the resulting DQ-only graph is bit-identical to the QDQ graph under onnxruntime — max abs diff 0.0e+00 across 457 quantizers.

tests/unit/onnx is 659 passed locally with 11 failures that also occur on pristine main in this environment (int4 paths needing cupy, three TestColumnMajorTransformation tests needing MSVC build tools). ruff check reports the same 3 pre-existing PLR0917 findings before and after.

Before your PR is "Ready for review"

  • Is this change backward compatible?: ✅ — a correctly emitted per-channel Q/DQ pair already declares the axis this conversion now reads, so well-formed graphs convert bit-identically; only graphs where the two disagreed change behaviour
  • If you copied code from any other sources or added a new PIP dependency, did you follow guidance in CONTRIBUTING.md: N/A
  • Did you write any new necessary tests?: ✅
  • Did you update Changelog?: ✅
  • Did you get Claude approval on this PR?: N/A

Additional Information

Fixes #2442.

#2613 edits _convert_weight against the lines this PR restructures, and #2567 touches the same function lower down. Happy to rebase in whatever order suits you.

…in qdq_to_dq

qdq_to_dq assumed DequantizeLinear feeds Conv/Gemm/MatMul directly, with only
Cast tolerated in between. A weight that reaches MatMul transposed -- as in
MaxViT's attention blocks -- put Transpose in front of _convert_weight, whose
axis_map has no entry for it:

    Unsupported op_type for real weight quantization: Transpose

Tracing through the Transpose is not enough on its own. axis_map is expressed in
the consumer's layout, while the scale indexes the weight as stored, so the axis
has to be mapped back through the Transpose's permutation. Skipping the Transpose
the way Cast is skipped raises "Scale shape (96,) does not match weight shape
(96, 32) along axis 1" on non-square weights, and on square weights (out == in,
common for attention projections) it silently quantizes along the wrong axis --
907 of 1024 elements wrong in a 32x32 case.

_get_successive_consumers now walks any Cast/Transpose chain and returns the
composed permutation; _convert_weight applies it to the axis, asserting the
permutation matches the weight's rank.

Verified on the reported model: quantized maxvit_tiny_rw_256 exported with
dq_only=True raises on main and exports here, and the resulting DQ-only graph is
bit-identical to the QDQ graph under onnxruntime (max abs diff 0.0 across 457
quantizers).

ONNX makes Transpose's `perm` optional and defaults it to reversing the input
axes, so asserting the attribute exists rejected a spec-valid graph. Derive the
reverse permutation from the weight's rank instead.

onnxruntime cannot execute DQ -> Transpose(no perm) -> MatMul at all (its QDQ
optimizer raises "vector too long"), so the regression test compares the
converted weight against the equivalent explicit permutation rather than
asserting runtime equivalence.

Use the source Q/DQ axis for conversion.

_convert_weight remaps the consumer axis through Transpose. For a valid square weight whose Q/DQ nodes use axis=1 before Transpose(perm=[1,0]), this produces conversion axis 0, while the retained DequantizeLinear still uses axis 1. The square shape allows the mismatch to pass validation, so dq_only export can silently produce different model outputs.

Read the axis from the source Q/DQ pair and use it when reshaping the scale and zero point. Do not derive the conversion axis from the consumer layout. Reject only a Q/DQ pair whose own axes disagree.

_convert_weight derived the conversion axis from the consumer op, but the
DequantizeLinear left in the graph dequantizes along the axis it declares. When
the two disagree the weight is quantized along the wrong axis, and for a square
weight the scale length still matches, so validation passes and dq_only export
silently changes the model's output.

Use the declared axis when the Q/DQ pair has one, keeping the consumer mapping
as the fallback for pairs that do not. This also fixes the same mismatch without
a Transpose, which reproduces on main: a square weight with axis=0 feeding
MatMul converts along axis 1 today.

A per-axis DequantizeLinear that omits `axis` dequantizes along axis 1, but the
fallback mapped the consumer's axis through the Transpose permutation instead.
For a square weight behind Transpose -> MatMul that picks axis 0, so the
conversion disagreed with the DQ left in the graph and silently changed the
model's output.

Per-axis conversion now takes the axis from the Q/DQ pair in every case,
declared or defaulted. That axis already indexes the stored weight whatever the
consumer's layout is, so the permutation is no longer needed to pick it and the
plumbing that carried it is gone; Transpose is still traced to reach the real
consumer. The consumer mapping remains for non-per-axis scales.

Review: trace Transpose in qdq_to_dq

Summary

The change is small, the reasoning behind it is right, and the second half (sourcing the axis from the Q/DQ pair rather than the consumer) is the more valuable of the two fixes. Two things I checked specifically and agree with:

  1. The invariant is the correct one. After conversion the DequantizeLinear stays in the graph with its input rewired to the weight initializer (qdq_utils.py:781), so its axis indexes the stored weight regardless of what happens downstream. Quantizing along that axis is what makes the conversion output-preserving. This also explains why the perm plumbing could be dropped in b9c43c8 — a downstream Transpose cannot change which axis the DQ indexes.
  2. It is a no-op on well-formed graphs. For every consumer in axis_map, the axis a correctly-emitted per-channel Q/DQ pair declares already equals the mapped value (Conv→0, ConvTranspose→1, Gemm per transB, MatMul→1). So existing models convert bit-identically; only graphs where the two disagreed — previously silently mis-quantized — change behavior.

Tracing through Cast/Transpose is also safe for a reason worth making explicit: since the axis no longer comes from the consumer, the traversal's only remaining job is the op_type not in axis_map allowlist gate. That makes the [0] first-consumer pick (qdq_utils.py:606) much less load-bearing than it was for Cast on main — a nice side effect of the axis change.

Test coverage looks right: the four axis × transpose combinations are covered across test_dq_transpose_matmul_matches_qdq (axis 0, with transpose) and test_conversion_follows_the_source_qdq_axis (the other three), and the square-weight cases are the ones that matter, since a wrong axis there passes the shape check.

Findings

1. scale_array.ndim == 1 also matches a one-element per-tensor scale — minor regression risk · qdq_utils.py:669

if scale_array.ndim == 1:
    axis = (1 if dq_axis is None else dq_axis) % len(weight_shape)

A per-tensor scale spelled as a 1-D tensor of one element with no axis on the DQ node now takes this branch and gets axis 1. Where axis_map would have picked a dimension of size 1, main converted successfully and this raises:

weight scale main this PR
Conv (1, 3, 3, 3) (1,), no axis converts (axis 0, 1 == 1) Scale shape (1,) does not match weight shape (1, 3, 3, 3) along axis 1
Gemm transB=1 (1, 64) (1,), no axis converts raises

A single-output-channel Conv is not exotic (segmentation/depth heads). The axis is mathematically irrelevant for a one-element scale — reshape_dims is all ones either way — so it only affects the validation check, and gating on size instead makes the change strictly additive:

if scale_array.size > 1:

Worth confirming whether any path reaching qdq_to_dq actually emits (1,) rather than a 0-d scale; if not, this is theoretical and folding it into #2561 alongside the scalar IndexError is reasonable. I'd just rather the gate not widen the per-tensor breakage. Fix this →

2. The QuantizeLinear axis is never cross-checked · qdq_utils.py:772

dq_axis = next((attr.i for attr in dq_node.attribute if attr.name == "axis"), None)

Only the DQ axis is read. If the Q node declares a different axis, the conversion follows the DQ and drops the Q, so the converted graph no longer matches the source graph's numerics — on a square weight, silently, which is exactly the failure class this PR exists to close. Such a pair is malformed and ModelOpt shouldn't emit one, but a two-line check turns "silently different output" into a loud error at no cost. Optional; CodeRabbit raised the same point and I think following the DQ is the right default, just that the disagreement deserves to be noisy. Fix this →

Nits

  • qdq_utils.py:673 — % len(weight_shape) handles negative axes (correct, ONNX allows them) but also silently wraps an out-of-range positive axis, e.g. axis=5 on a rank-2 weight becomes 1. An invalid model either way; a bounds check would report it instead of quantizing.
  • qdq_utils.py:670-672 — the three-line comment leans toward restating the reasoning; CONTRIBUTING asks for one or two lines. The first sentence carries it.
  • test_qdq_utils.py:1165 — perm: list[int] | None = (1, 0) annotates a list but defaults to a tuple.
  • test_dq_transpose_matmul_matches_qdq and test_conversion_follows_the_source_qdq_axis are near-identical ORT before/after comparisons; one parametrization over (out, in, q_axis, transpose, declare_axis) would cover both and drop ~25 lines. Only if you're touching the file anyway.
  • Now that perm is unused in the source, test_dq_transpose_without_perm_is_traced asserts only that the traversal reaches the MatMul — which the name and docstring say accurately. Fine as cheap coverage.

CHANGELOG

Two sentences, user-facing symptom first, no root-cause detail — matches the guideline.

The linux / unit-pr-required-check failures on this run are an infrastructure flake, not this PR — no test executed. The job died during dependency installation:

nox > Command uv pip install 'torchvision~=0.29.0' -e '.[all,dev-test]' failed with exit code 2:
error: Request failed after 3 retries in 128.8s
  cause: Failed to fetch: `https://pypi.org/simple/click/`
  cause: error sending request for url (https://pypi.org/simple/click/)
nox > Session unit-3.12(torch_214, tf_latest) failed.

pypi.org was unreachable for ~129s. code-quality passed on the same commit, the scheduled main run passed at 00:04 and other PRs' unit jobs passed at ~06:07, so this looks transient rather than repo-wide. This PR changes only modelopt/onnx/quantization/qdq_utils.py, its test module and CHANGELOG.rst — nothing dependency-related.

Could someone re-run the failed jobs when convenient? I can't trigger a re-run myself, and I would rather not push a no-op commit since that would reset the copy-pr-bot approval this run needed.

Locally tests/unit/onnx is 655 passed with 11 failures that are environmental on my Windows box (int4 paths needing cupy, and three TestColumnMajorTransformation tests needing MSVC build tools) and reproduce identically on pristine main.

… Q/DQ axes

Review caught a regression: gating the per-axis branch on `ndim == 1` also
matched a per-tensor scale spelled as a one-element 1-D tensor. A weight whose
consumer axis has length 1 -- a single-output-channel Conv, a Gemm with one
output -- converted on main and started raising here, because the branch picked
the DQ's default axis 1 and the shape check then rejected it. Gate on the
element count instead, so a single scale keeps using the consumer axis; the axis
is irrelevant for a scale that is broadcast anyway.

Also, since the conversion follows the DequantizeLinear and drops the
QuantizeLinear, a per-axis pair that disagrees on the axis would silently change
the output. Compare the two effective axes and raise instead. Nodes that omit
the attribute default to 1, so a pair that declares it on only one side is not
a disagreement.

Bounds-check the axis rather than letting the modulo wrap an out-of-range one,

Thanks — finding 1 was a real regression and I have fixed it in 4ba0613.

Finding 1 (one-element scale). Confirmed before changing anything. On main both of these convert with max diff 0 and on the previous commit both raised:

weight consumer main previous commit
(1, 3, 3, 3) Conv converts Scale shape (1,) does not match weight shape (1, 3, 3, 3) along axis 1
(1, 64) Gemm transB=1 converts raises

Gating on scale_array.size > 1 as suggested, so a single broadcast scale keeps using the consumer axis. test_one_element_scale_is_not_per_axis covers the Conv case end to end through onnxruntime.

Finding 2 (Q/DQ axis cross-check). Added, with one adjustment: comparing the raw attributes would have flagged a pair that declares axis on only one side, which is not a disagreement since ONNX defaults it to 1. It now compares effective axes, and only for per-axis scales, since the axis is meaningless for a broadcast one. Verified no false positives across q=1/dq=1, q=None/dq=None, q=1/dq=None, q=None/dq=1, and that a genuine q=0/dq=1 pair raises.

Nits. Bounds-check instead of letting the modulo wrap an out-of-range axis; comment trimmed to two lines; the tuple/list annotation fixed; the two near-identical ORT comparisons folded into one five-case parametrization.

tests/unit/onnx is 657 passed locally, with the same 11 failures that reproduce on pristine main here (int4 paths needing cupy, three TestColumnMajorTransformation tests needing MSVC build tools). The quantized maxvit_tiny_rw_256 export from #2442 still produces a DQ-only graph bit-identical to the QDQ graph under onnxruntime.

On the point about not verifying by execution: that is worth flagging back — I could not reproduce finding 1 by reading either, it only showed up when I built the single-output-channel Conv and ran it.

@ajrasane — sorry to ping directly; this is about the copy-pr-bot gate rather than review time.

This PR was vetted once, but the run hit a transient pypi failure during uv pip install (Failed to fetch https://pypi.org/simple/click/) so no test actually executed, and the follow-up commit addressing @gcunhase's review then reset the approval. It has not had a green run yet.

I have four other small ONNX fixes in the same state, if they are easy to batch:

PR
#2553 AutoCast calibration memory is linear in sample count (fixes #2337)
#2567 qdq_to_dq writes an INT8 weight next to a UINT8 zero point, so the export will not load
#2575 FP64 narrowing turns ±DBL_MAX into ±inf; FP16 underflow drops the sign
#2583 the column-major DQ surgery ignores a negative axis

All branched from main, independent, no overlapping files between them. Each has regression tests that fail on main and pass on the branch; I have run tests/unit/onnx locally on every one, but local results are not worth much next to your CI, which is why I am asking.

No urgency on the review itself — just the vetting step, so the suites can run and you are not reviewing something unverified.

One sequencing note while you are here: #2613 (per-tensor scales, fixes an issue I filed) edits _convert_weight directly against the lines this PR restructures, and #2567 touches the same function lower down. I left the details on #2613 and am happy to rebase in whatever order suits you.

@gcunhase thanks for the review trigger — the regression it surfaced is fixed in 4ba0613.

CI hasn't run since that push. The only run on this PR was on 3ce246b, where unit-pr-required-check and linux both died during dependency installation (uv pip install → Failed to fetch https://pypi.org/simple/... after 3 retries), so no test actually executed. Since copy-pr-bot vets per-SHA, 4ba0613 needs a fresh /ok to test before anything can report.

Could you issue one when convenient? Contributors can't re-run jobs here — Must have admin rights.

Changes requested: transposed weights with a one-element scale can still fail conversion because validation uses the consumer’s axis.

Needs action:

  • Fix single-scale broadcasting in _convert_weight and add an ORT-equivalence regression for a (1, 32) weight followed by Transpose -> MatMul; see inline comment.
  • Update the PR description to reflect the final implementation: it uses Q/DQ axes, not composed transpose permutations or a consumer-axis fallback for omitted attributes.

Comment thread modelopt/onnx/quantization/qdq_utils.py Outdated
A one-element scale was routed to the consumer's axis_map entry, which only
converts when that dimension happens to be 1. A single-output projection is the
counterexample: weight (1, 32) with a (1,) scale picked MatMul axis 1 and failed
the length check against 32. It fails the same way without a Transpose, so the
gate was wrong rather than the tracing.

A single scale covers the whole weight. It broadcasts, and no axis applies to
it, so leave reshape_dims all ones and run the length check only for a per-axis
scale.

That leaves nothing reading axis_map's values -- the per-axis branch takes its
axis from the Q/DQ pair -- so it becomes the set of supported consumers it was
really being used as, and the Gemm transB lookup that fed it goes with it.

One consequence worth flagging: a scalar scale now converts as well, which is
the subject of NVIDIA#2613.

For anyone checking CI here: two things worth noting, neither caused by this PR.

The unit-pr-required-check: FAILURE currently shown is stale. Two workflow runs fired on this commit within the same second; the first had linux/build-docs/code-quality/check-file-changes all cancelled before completing, but its aggregator recorded failure anyway rather than cancelled. A second, clean run started immediately after — its own linux completed successfully.

multi-version (unit-3.12(torch_214, tf_min)) is a real failure in that run, but unrelated to this PR: every error is a collection-time ImportError: cannot import name 'BucketNotFoundError' from 'huggingface_hub.errors', across 15+ test files (puzzletron, speculative decoding, diffusers, opt plugins) — none of them touch qdq_utils.py or _convert_weight. This diff only changes CHANGELOG.rst, modelopt/onnx/quantization/qdq_utils.py, and its test file. Looks like a dependency-version mismatch in the tf_min nox environment itself.

Not pushing anything for either.

Approved: the prior correctness concerns are resolved, with regression coverage for source/default axes, omitted Transpose permutations, and single-scale broadcasting.

No action needed:

  • ✔️ Resolved since the last review: axis selection and disagreement validation, transposed single-output weights, and the stale PR description. The minor changelog concern is also addressed.
  • Existing tests remain intact; the new tests check ORT output equivalence and directly verify the omitted-permutation conversion.

Thanks for merging main in, @gcunhase. The two remaining red checks trace to the same root cause, and neither is this PR:

trtllm (gpt-oss) / run-test fails on tests/examples/gpt-oss/test_gpt_oss_sft_toy with a subprocess.CalledProcessError. The job log itself prints a version-pin warning before the failure: torch 2.14 pins cuDNN 9.24: mixing them fails with CUDNN_SUBLIBRARY_LOADING_FAILED — a known environment incompatibility, not anything in qdq_utils.py. This is the identical failure I ran into and confirmed unrelated on #2645 a day ago.

codecov/project shows -3.81% project coverage, but its own report says "All modified and coverable lines are covered by tests" for this diff. The drop is 2713 previously-covered lines losing coverage project-wide with only +1 net line changed here — consistent with the gpt-oss job failing/skipping and fewer lines executing in this particular run, not a regression this PR introduced.

Not pushing anything for either.

### What does this PR do?

Type of change: Bug fix

`MFTLoss.forward` flattens both logit tensors to `(batch * positions,
vocab)` and its docstring only assumes the class dimension is last, so
leading dimensions are clearly meant to be allowed:

```python
soft_log_probs = soft_log_probs.view(-1, soft_log_probs.size(-1))   # (new B, C)
target_logits  = target_logits.view(-1, target_logits.size(-1))     # (new B, C)
soft_targets = self._prepare_corrected_distributions(target_logits, labels, ...)
```

The labels were passed through untouched, and
`_prepare_corrected_distributions` rejects anything that is not 1-D:

```
ValueError: Logits must be a 2D tensor and labels must be a 1D tensor.
```

So the shapes a language model actually produces — `(batch, seq_len,
vocab)` logits against `(batch, seq_len)` labels — cannot be used:

| logits | labels | on `main` | this PR |
|---|---|---|---|
| `(2, 8, 50)` | `(2, 8)` | `ValueError` | converges, matches the
flattened form exactly |
| `(16, 50)` | `(16,)` | works | unchanged |

That is the setting Minifinetuning (arXiv:2506.15702) is for, so in
practice a caller had to flatten the labels themselves and nothing
documented that.

Flattening them alongside the logits fixes it, and the docstring now
says what shape the labels are expected in.

### Testing

`test_mft_loss_accepts_sequence_shaped_logits` drives `MFTLoss` at `(2,
8, 50)` / `(2, 8)` and asserts the result equals the pre-flattened `(16,
50)` / `(16,)` call. It fails on `main` with the `ValueError` above and
passes here.

Worth noting why this was not caught: the existing
`test_distillation_model_mft` drives `MFTLoss` through a vision model,
whose logits are already `(batch, classes)` and labels already
`(batch,)`, so the flattening never does anything there.

`tests/unit/torch/distill` is 30 passed, 1 skipped locally. The skip is
`plugins/test_huggingface_kd.py`, which needs `transformers` and is not
installed in my environment; it exercises `LogitsDistillationLoss`,
which this change does not touch.

### Before your PR is "*Ready for review*"

- Is this change backward compatible?: ✅ — already-1-D labels reshape to
themselves, so existing callers are unaffected
- If you copied code from any other sources or added a new PIP
dependency, did you follow guidance in `CONTRIBUTING.md`: N/A
- Did you write any new necessary tests?: ✅
- Did you update
[Changelog](https://github.com/NVIDIA/Model-Optimizer/blob/main/CHANGELOG.rst)?:
✅
- Did you get Claude approval on this PR?: N/A

### Additional Information

Unrelated to my open ONNX PRs (#2553, #2554, #2567, #2575, #2583) — no
shared files.

One thing I noticed next door and did not touch, in case it is of
interest: `LogitsDistillationLoss` defaults to `reduction="mean"`, while
`MFTLoss` in the same file defaults to `"batchmean"`. PyTorch warns on
every call that `"mean"` is not the KL divergence value and that it will
be changed to behave as `"batchmean"` in a future major release, so the
default path is currently a factor of the vocabulary size away from the
other two reductions and will shift silently when that lands. Changing a
training default is your call rather than mine, so I have left it alone
— happy to open a separate issue if useful.
